Every gradient descent algorithm in the world finds correlations. That's what they do — they identify statistical associations between inputs and outputs. And for many problems, that's enough. Image classification, language modeling, recommendation engines — these are problems where correlation-based approaches have delivered extraordinary results.
But there's a class of problems where correlation hits a hard ceiling. These are problems where you need to know not just what happened, but what will happen when you intervene.
The Do-Calculus Gap
Consider a simple example from marketing. A correlation-based model might tell you that customers who saw your ad and then purchased have a strong association — P(purchase | ad_exposure) is high. But this tells you nothing about whether the ad caused the purchase. Those customers might have purchased anyway.
What you actually need is the interventional distribution: P(purchase | do(show_ad)). This is the probability of purchase when you actively intervene and show the ad, versus when you don't. The difference between these two quantities — the observational and interventional distributions — is the causal effect. And it's the only number that tells you whether your ad spend is working.

When you're managing a $200M security operations budget, the difference between correlation and causation is the difference between wasted investment and measurable, defensible ROI. When you're optimizing network performance across 10,000 applications, you need to know which changes will actually improve latency — not which changes happened to co-occur with improvements.
